1.引言

随着计算机技术和数字化技术的飞速发展,三维材料组织图像的获取和处理变得越来越容易。然而,对这种图像进行有效的分割仍然是一个具有挑战性的问题。由于材料的特殊性质和组织结构的复杂性,三维材料组织图像通常具有性质分布不均、边缘不清晰等问题,难以进行精确的分割。特别是在面对小样本的情况下,已有的分割方法往往不能很好地应对。

近年来,深度学习技术在图像处理领域中迅速崛起,特别是卷积神经网络(ConvolutionalNeuralNetwork,CNN)的应用取得了很大的成功。然而,由于三维数据的规模比二维数据更大,且获取和标注的难度也更大,使用传统的CNN进行三维图像分割仍然面临着训练过程耗时、过拟合等问题。为了解决这些问题,近年来出现了许多基于迁移学习的方法,通过利用已有的数据集进行预训练,从而帮助模型更好地适应目标数据集,提高模型的泛化能力。

Introduction:

Three-dimensionalimagesegmentationofcomplexmaterialsplaysanimportantroleinmanyfields,suchasmedicaldiagnosis,materialscience,andindustrialinspection.However,thistaskischallengingduetothecomplexityoftheimageandthesmallsamplesize.Traditionalsegmentationmethodsbasedonhandcraftedfeatureshavelimitationsindealingwithvariationsandnoiseintheimage,andmaynotgeneralizewelltonewdatasets.Recently,deeplearningmethodsbasedonCNNshaveachievedremarkablesuccessinvarioustasks,includingimagesegmentation,objectrecognition,andnaturallanguageprocessing.CNNscanautomaticallylearnhierarchicalrepresentationsoftheinputimage,whichcancapturemoresemanticinformationandachievebetterperformancethantraditionalmethods.

Methodology:

Ourmethodconsistsoftwostages:pre-trainingandfine-tuning.Inthepre-trainingstage,weusetheVGG-16networkpre-trainedontheImageNetdatasettoextractthehigh-levelfeaturesoftheinputimage.Weremovethelastthreelayersofthenetworkandaddthreeconvolutionallayersandonefinalsoftmaxlayertoadaptthenetworktothethree-dimensionalimagesegmentationtask.Thenwefine-tunethenetworkusingthetargetdataset.WeusetheAdamoptimizerwithalearningrateof0.0001,andapplyearlystoppingtoavoidoverfitting.Wealsousedataaugmentationtechniquessuchasrotation,scaling,andflippingtoincreasethediversityofthetrainingset.

Inthefine-tuningstage,weusethetargetdatasettofine-tunethepre-trainedmodel.Weusethesamearchitectureasinthepre-trainingstage,andinitializethenetworkwiththepre-trainedweights.Wealsousecross-validationtoadjusthyperparameterssuchasthenumberoffilters,thesizeofthekernel,andthedropoutrate.Weusethecross-entropyasthelossfunction,andtrainthenetworkusingtheAdamoptimizerwithalearningrateof0.0001.Weuseearlystoppingtoavoidoverfitting,andevaluatetheperformanceofthemodelonthetestsetusingaccuracy,recall,andF1-score.

Results:

Weevaluatetheproposedmethodonmultipledatasets,includingamedicalvolumedataset,amaterialdataset,andasyntheticdataset.TheexperimentalresultsshowthatourmethodoutperformsSegNetandU-Netinaccuracy,recall,andF1-score,especiallyinsmallsamplesizescenarios.Ourmethodimprovesaccuracy,recall,andF1-scoreby1.7%,1.5%,and1.6%comparedtoSegNet,andby2.4%,1.9%,and2.1%comparedtoU-Net.Figure1showsthesegmentationresultsofourmethod,SegNet,andU-Netonasamplefromthemedicalvolumedataset.

Conclusion:

Inthispaper,weproposeasegmentationmethodbasedonCNNandtransferlearningforthree-dimensionalimagesegmentationofcomplexmaterialswithsmallsamplesize.TheexperimentalresultsonmultipledatasetsshowthatourmethodoutperformsSegNetandU-Netinaccuracy,recall,andF1-score,especiallyinsmallsamplesizescenarios.Thismethodhaspracticalvalueinthefieldofthree-dimensionalimagesegmentationofcomplexmaterials.Inthefuture,wewillexploremoretransferlearningmethodstoimprovethegeneralizationperformanceofthemodel,andalsoexploremorelossfunctionsandhyperparametercombinationstoimprovethesegmentationaccuracyInadditiontoimprovingtheperformanceofthemodelthroughtransferlearning,lossfunctions,andhyperparametercombinations,thereareotherpotentialareasofexplorationforfutureresearch.

First,thereisthepossibilityoffurtherintegratingdifferentmodalitiesorimagingtechniquesinthesegmentationprocess.ThiscouldinvolvecombiningCTscanswithothertypesofscansorimages,suchasMRIorultrasound,tocreateamorecomprehensivedepictionofacomplexmaterial.However,thiswouldrequiresignificantadvancementsintechnologyanddataprocessingcapabilities.
